Build SupportPilot: a production LangGraph agent

A customer-support agent that answers policy questions from a knowledge base, looks up orders, opens tickets, and issues refunds — pausing for a human supervisor when the amount is large. Then we containerise it so the same image deploys to GCP, AWS and Azure.

1. Requirements & design

1

Write down what "done" means

Real projects start with requirements, and interviewers love hearing them:

  • Functional: answer policy questions with citations; check order status; open tickets; issue refunds within policy.
  • Safety: refunds over $100 need human approval; never ask for passwords; resist prompt injection.
  • Non-functional: conversations survive restarts and scale-out (stateless containers + Postgres); token streaming; p95 first-token < 2s; traceable.
  • Portability: one Docker image, configured by environment variables, runs on any cloud.
START guard agent tools human_approval END refund > $100 rejected → agent
The SupportPilot graph. Dashed: guard blocks the request.

3. Configuration

3

Twelve-factor settings

Everything that differs between laptop and cloud comes from environment variables. Cloud secret managers inject them at runtime — no secrets in the image.

from functools import lru_cache

4. Knowledge base (RAG)

4

Retrieval behind a tool

We start with BM25 keyword search so the project runs with zero extra API keys. Because retrieval sits behind a tool, you can later swap in a vector store without touching the graph.

"""Tiny knowledge base: markdown files -> paragraph chunks -> BM25 keyword search.

BM25 needs no embedding API key, which keeps the tutorial runnable anywhere.
In production swap this for a vector store (pgvector, Vertex AI Vector Search,
OpenSearch, Azure AI Search) plus a reranker - the tool interface stays the same.

# Refund policy
Customers can request a full refund within 30 days of delivery for unused items.
Refunds above 100 USD require approval by a support supervisor.
Digital gift cards are non-refundable.
Refunds are returned to the original payment method within 5-7 business days.

5. Tools

Docstrings become the tool descriptions the model reads. Every tool validates inputs, returns errors as text (so the agent can recover), and the refund is idempotent.

6. The LangGraph agent

6

Guard → agent ⇄ tools, with a human-approval branch

Key ideas in this file:

  • guard is a cheap, deterministic check that runs before any tokens are spent, and returns Command(goto=...) to route.
  • route_after_agent sends risky tool calls to human_approval instead of executing them.
  • interrupt() pauses the graph and checkpoints state; Command(resume=...) continues it — possibly hours later on a different container.
  • On rejection we still return a ToolMessage for every tool call — LLM APIs reject a tool call without a matching result.
  • build_graph(llm=...) accepts an injected model, which makes testing trivial.
"""The SupportPilot LangGraph agent.

    START -> guard -> agent -> (tools | human_approval | END)

For richer scoring (LLM-as-judge, dashboards, regression comparisons) push the same dataset to LangSmith and use langsmith.evaluate().

11. Observability

11

Trace every step

Set LANGSMITH_TRACING=true and LANGSMITH_API_KEY: every node, LLM call, tool call, token count and latency is traced with zero code changes. Prefer open source? Use Langfuse or OpenTelemetry instrumentation and ship traces to Cloud Trace, X-Ray or Application Insights.

Metrics worth a dashboard:

  • Resolution rate, escalation (ticket) rate, approval rate/latency
  • Tokens and cost per conversation; p50/p95 latency; tool error rate
  • Guard block rate (spikes = attack or false positives)

12. Production hardening

12

Before real users touch it

  • AuthN/Z: put the API behind your identity provider; derive user_id from the token, never from the request body; only supervisors may call /approve.
  • Thread ownership: namespace thread_id by user so one user can't resume another's conversation.
  • Real tools: replace the in-memory dicts with calls to your order/ticket services using scoped service credentials.
  • Rate limits & budgets: per-user request limits, recursion_limit, LLM timeouts, max tokens.
  • Data: PII redaction in logs/traces; retention policy for checkpoints.
  • Resilience: retries with backoff on LLM calls, a fallback model (llm.with_fallbacks([...])), health checks, multiple replicas.
  • Schema migrations: run saver.setup() from a one-off job in CI/CD rather than on every container start when you scale out.

Deploy it

You now have one image configured by four environment variables (MODEL, the provider API key, DATABASE_URL, optional LangSmith keys). Pick a cloud:
